IntroductionWe propose a scalable open-source framework for large-scale distributeddeep learning on GPU clusters. We build the framework upon the Caffe CNNlibraries and the Petuum distributed ML framework as a starting point, butgoes further by implementing three key contributions for efficient CNNtraining on clusters of GPU-equipped machines: (i) a three-level hybridarchitecture to support both CPU-only clusters as well as GPU-equippedclusters, (ii) a distributed wait-free backpropagation (DWBP) algorithm toimprove GPU utilization and to balance communication, and (iii) a dedicatedstructure-aware communication protocol (SACP) to minimize communicationoverheads. We empirically show that our framework converges to the sameobjective value as a single machine, and achieves state-of-art trainingspeedup across multiple models and well-established datasets, using acommodity GPU cluster of 8 nodes.
Background: Iterative-Convergent AlgorithmsIterative-Convergent Algorithm in GeneralThe iterative-convergent algorithm can be represented as follows.
𝐴𝐴(𝑡𝑡) = 𝐹𝐹 (𝐴𝐴 𝑡𝑡−1 ,Δℓ (𝐴𝐴(𝑡𝑡−1),𝐷𝐷))In large-scale machine learning, both data 𝐷𝐷 and model 𝐴𝐴 can be very large.
𝐴𝐴(𝑡𝑡) = 𝐹𝐹 (𝐴𝐴 𝑡𝑡−1 ,𝑝𝑝=1
